Understanding the Requirements for Surveys to Support Satellite-Based Crop Type Mapping: Evidence from Sub-Saharan Africa

Abstract
With the surge in publicly available high-resolution satellite imagery, satellite-based monitoring of smallholder agricultural outcomes is gaining momentum. This paper provides recommendations on how large-scale household surveys should be conducted to generate the data needed to train models for satellite-based crop type mapping in smallholder farming systems. The analysis focuses on maize cultivation in Malawi and Ethiopia, and leverages rich, georeferenced plot-level data from national household surveys that were conducted in 2018–20 and that are integrated with Sentinel-2 satellite imagery and complementary geospatial data. To identify the approach to survey data collection that yields optimal data for training remote sensing models, 26,250 in silico experiments are simulated within a machine learning framework. The best model is then applied to map seasonal maize cultivation from 2016 to 2019 at 10-meter resolution in both countries. The analysis reveals that smallholder plots with maize cultivation can be identified with up to 75 percent accuracy. However, the predictive accuracy varies with the approach to georeferencing plot locations and the number of observations in the training data. Collecting full plot boundaries or complete plot corner points provides the best quality of information for model training. Classification performance peaks with slightly less than 60 percent of the training data. Seemingly small erosion in accuracy under less preferable approaches to georeferencing plots results in total area under maize cultivation being overestimated by 0.16 to 0.47 million hectares (8 to 24 percent) in Malawi.

    Climate and Social Sustainability in Fragility, Conflict, and Violence Contexts

    Climate change is widely recognized as a driver of violent conflict, but its broader social effects remain less understood. Ignoring these dimensions risks a vicious cycle where climate policies might undermine socially just adaptation. Evidence is still limited on how climate shocks influence political participation, trust, or migration. This paper helps fill that gap by examining links between climate change, conflict, and social sustainability, with a focus on inclusion, resilience, cohesion, and legitimacy. Using secondary data from 2019–24, the study applies simple correlation-based methods to test three hypotheses on the nature, severity, and composition of these associations. The analysis combines multiple climate impact measures, new conflict classifications, recent social sustainability frameworks, and controls for population and geography. The results reveal strong correlations—not causation—between climate events and contexts of fragility, conflict, and violence. Climate impacts are most pronounced in both national and subnational conflict settings. The study also finds robust links between fragility, conflict, and violence and low levels of social sustainability, reflecting its role as both a driver and consequence of conflict. Some dimensions—such as violent events and insecurity—appear weaker in areas most affected by climate shocks. Two of the hypotheses are supported, and one remains inconclusive.

    The Macroeconomic Implications of Climate Change Impacts and Adaptation Options

    Estimating the macroeconomic implications of climate change impacts and adaptation options is a topic of intense research. This paper presents a framework in the World Bank's macrostructural model to assess climate-related damages. This approach has been used in many Country Climate and Development Reports, a World Bank diagnostic that identifies priorities to ensure continued development in spite of climate change and climate policy objectives. The methodology captures a set of impact channels through which climate change affects the economy by (1) connecting a set of biophysical models to the macroeconomic model and (2) exploring a set of development and climate scenarios. The paper summarizes the results for five countries, highlighting the sources and magnitudes of their vulnerability --- with estimated gross domestic product losses in 2050 exceeding 10 percent of gross domestic product in some countries and scenarios, although only a small set of impact channels is included. The paper also presents estimates of the macroeconomic gains from sector-level adaptation interventions, considering their upfront costs and avoided climate impacts and finding significant net gross domestic product gains from adaptation opportunities identified in the Country Climate and Development Reports. Finally, the paper discusses the limits of current modeling approaches, and their complementarity with empirical approaches based on historical data series. The integrated modeling approach proposed in this paper can inform policymakers as they make proactive decisions on climate change adaptation and resilience.

    Institutional Capacity for Policy Implementation: An Analytical Framework

    State capacity is an important prerequisite for policy implementation, yet at the country level it is difficult to measure, assess, and reform. This paper proposes a focus on institutional capacity: the ability of public institutions to implement the specific policy mandates for which they are responsible. Based on a review of existing literature, the paper defines the different dimensions that compose institutional capacity and groups them into two cross-cutting categories: organizational dimensions (personnel, financial resources, information systems, and management practices) and governance dimensions (transparency, independence, and accountability). The paper proposes measures for organizational and governance dimensions using existing data, shows intra-institutional variation of these measures within countries, and discusses how new data could be collected for better measurement of these concepts. Finally, the paper illustrates how the framework can be used to diagnose the sources of common problems related to weak policy implementation.

    South Africa’s Fragmented Cities: The Unequal Burden of Labor Market Frictions

    Using high-resolution administrative, census, and satellite data, this paper shows that South African cities are characterized by spatial mismatches between where people live and where jobs are located, relative to 20 global peers. Areas within 5 kilometers of commercial centers have 9,300 fewer residents per square kilometer than expected, which is 60 percent below the global median. Poor, dense neighborhoods are most affected. In Johannesburg, a 10-percentile increase in distance from the nearest business hub corresponds to a 3.7-percentile drop in asset wealth (a proxy of household wellbeing) and 4.9-percentile drop in employment. In Cape Town, the declines are 4.0 and 3.7 percentiles, respectively. Employment is 87 percent lower in the poorest decile than the richest in Johannesburg and 61 percent lower in Cape Town. These findings suggest that South Africa’s spatial organization of people and economic activity constrains agglomeration and reinforces inequality. This methodology provides a scalable and standardized data-driven framework to analyze spatial accessibility and agglomeration frictions in complex, data-constrained urban systems.

    Investment in Emerging and Developing Economies

    The world faces a pressing challenge to meet key development objectives amid slowing growth and rising macroeconomic and geopolitical risks. With the number of job seekers rising rapidly, infrastructure shortfalls continuing to be large, and climate costs mounting, the case for a significant investment push has never been stronger. Yet the capacity to respond in many emerging markets and developing economies has eroded. Since the global financial crisis, investment growth has slowed to about half its pace in the 2000s, with both public and private investment weakening. Foreign direct investment inflows—a critical source of capital, technology, and managerial know-how—have also fallen sharply and become increasingly concentrated, leaving low-income countries with only a marginal share. The risks of further retrenchment are significant, as trade tensions, policy uncertainty, and elevated debt levels continue to weigh on investment. Reigniting momentum will require ambitious domestic reforms to strengthen institutions, rebuild macro-fiscal stability, and deepen trade and investment integration—the foundations of a supportive business climate. At the same time, international cooperation is indispensable. A renewed commitment to a predictable system of cross-border trade and investment flows, combined with scaled-up financial support and sustained technical assistance, is essential to help emerging markets and developing economies—especially low-income countries and economies in fragile and conflict situations—bridge financing gaps and implement the domestic reforms needed to restore investment as an engine of growth, jobs, and development.

    Eyes in the Sky, Boots on the Ground

    Crop yields in smallholder systems are traditionally assessed using farmer-reported information in surveys, occasionally by crop cuts for a sub-section of a farmer's plot, and rarely using full-plot harvests. Accuracy and cost vary dramatically across methods. In parallel, satellite data is improving in terms of spatial, temporal, and spectral resolution needed to discern performance on smallholder plots. This study uses data from a survey experiment in Uganda, and evaluates the accuracy of Sentinel-2 imagery-based, remotely-sensed plot-level maize yields with respect to ground-based measures relying on farmer self-reporting, sub-plot crop cutting (CC), and full-plot crop cutting (FP). Remotely-sensed yields include two versions calibrated to FP and CC yields (calibrated), and an alternative based on crop model simulations, using no ground data (uncalibrated). On the ground, self-reported yields explained less than 1 percent of FP (and CC) yield variability, and while the average difference between CC and FP yields was not significant, CC yields captured one-quarter of FP yield variability. With satellite data, both calibrated and uncalibrated yields captured FP yield variability on pure stand plots similarly well, and both captured half of FP yield variability on pure stand plots above 0.10 hectare. The uncalibrated yields were consistently 1 ton per hectare higher than FP or CC yields, and the satellite-based yields were less well correlated with the ground-based measures on intercropped plots compared with pure stand ones. Importantly, regressions using CC, FP and remotely-sensed yields as dependent variables all produced very similar coefficients for yield response to production factors.

    Estimating the Impact of Weather on Agriculture

    This paper quantifies the significance and magnitude of the effect of measurement error in remote sensing weather data in the analysis of smallholder agricultural productivity. The analysis leverages 17 rounds of nationally-representative, panel household survey data from six countries in Sub-Saharan Africa. These data are spatially linked with a range of geospatial weather data sources and related metrics. The paper provides systematic evidence on measurement error introduced by (1) different methods used to obfuscate the exact GPS coordinates of households, (2) different metrics used to quantify precipitation and temperature, and (3) different remote sensing measurement technologies. First, the analysis finds no discernible effect of measurement error introduced by different obfuscation methods. Second, it finds that simple weather metrics, such as total seasonal rainfall and mean daily temperature, outperform more complex metrics, such as deviations in rainfall from the long-run average or growing degree days, in a broad range of settings. Finally, the analysis finds substantial amounts of measurement error based on remote sensing products. In extreme cases, the data drawn from different remote sensing products result in opposite signs for coefficients on weather metrics, meaning that precipitation or temperature drawn from one product purportedly increases crop output while the same metrics drawn from a different product purportedly reduces crop output. The paper concludes with a set of six best practices for researchers looking to combine remote sensing weather data with socioeconomic survey data.

    Mapping the World Population One Building at a Time

    High resolution datasets of population density which accurately map sparsely distributed human populations do not exist at a global scale. Typically, population data is obtained using censuses and statistical modeling. More recently, methods using remotely-sensed data have emerged, capable of effectively identifying urbanized areas. Obtaining high accuracy in estimation of population distribution in rural areas remains a very challenging task due to the simultaneous requirements of sufficient sensitivity and resolution to detect very sparse populations through remote sensing as well as reliable performance at a global scale. Here, the authors present a computer vision method based on machine learning to create population maps from satellite imagery at a global scale, with a spatial sensitivity corresponding to individual buildings and suitable for global deployment.

    The Mismeasure of Weather

    The availability of weather data from remotely sensed Earth observation data has reduced the cost of including weather variables in econometric models. Weather variables are common instrumental variables used to predict economic outcomes and serve as an input in modeling crop yields for rainfed agriculture. The use of Earth observation data in econometric applications has only recently been met with critical assessment of the suitability and quality of these data in economics. This paper quantifies the significance and magnitude of the effect of measurement error in Earth observation data in the context of smallholder agricultural productivity. The paper shows that different Earth observation sources use different measurement methods. The findings are not robust to the choice of Earth observation dataset, and the outcomes are not simply affine transformations of one another. Thus, the paper suggests that researchers should exercise caution in using these data and include robustness checks that test alternative sources of Earth observation data.

    Up in Smoke? Agricultural Commercialization, Rising Food Prices and Stunting in Malawi

    Diversification into high-value cash crops among smallholders has been propagated as a strategy to improve welfare in rural areas. However, the extent to which cash crop production spurs projected gains remains an under-researched question, especially in the context of market imperfections leading to non-separable production and consumption decisions, and price shocks to staple crops that might be displaced on the farm by cash crops. This study is a contribution to the long-standing debate on the links between commercialization and nutrition. It uses nationally-representative household survey data from Malawi, and estimates the effect of household adoption of an export crop, namely tobacco, on child height-for-age z-scores. Given the endogenous nature of household tobacco adoption, the analysis relies on instrumental variable regressions, and isolates the causal effect by comparing impact estimates informed by two unique samples of children that differ in their exposure to an exogenous domestic staple food price shock during the early child development window (from conception through two years of age). The analysis finds that household tobacco production in the year of or the year after child birth, combined with exposure to an exogenous domestic staple food price shock, lowers the child height-for-age z-score by 1.27, implying a 70-percent drop in z-score. The negative effect is, however, not statistically significant among children who were not exposed to the same shock. The results put emphasis on the food insecurity and malnutrition risks materializing at times of high food prices, which might have disproportionately adverse effects on uninsured cash crop producers.

    Global growth is expected to hold steady at 2.7 percent in 2025-26. However, the global economy appears to be settling at a low growth rate that will be insufficient to foster sustained economic development—with the possibility of further headwinds from heightened policy uncertainty and adverse trade policy shifts, geopolitical tensions, persistent inflation, and climate-related natural disasters. Against this backdrop, emerging market and developing economies are set to enter the second quarter of the twenty-first century with per capita incomes on a trajectory that implies substantially slower catch-up toward advanced-economy living standards than they previously experienced. Without course corrections, most low-income countries are unlikely to graduate to middle-income status by the middle of the century. Policy action at both global and national levels is needed to foster a more favorable external environment, enhance macroeconomic stability, reduce structural constraints, address the effects of climate change, and thus accelerate long-term growth and development.

    International Financial Reporting Standards : A Practical Guide, 5th Edition

    The publication of this fifth edition coincides with the convergence in accounting standards that has been a feature of the international landscape since the global financial crisis of 1998. The events of that year prompted several international organizations, including the World Bank and the International Monetary Fund, to launch a cooperative initiative to strengthen the global financial architecture and to seek a longer-term solution to the lack of transparency in financial information. A conscious decision has been made to focus on the needs of executives and financial analysts in the private and public sectors who might not have a strong accounting background. This publication summarizes each standard so managers and analysts can quickly obtain a broad overview of the key issues. Detailed discussion of certain topics has been excluded to maintain the overall objective of providing a useful tool to managers and financial analysts. In addition to the short summaries, most chapters contain basic examples that emphasize the practical application of some key concepts in a particular standard. This text provides the tools to enable an executive without a technical accounting background to: (1) participate in an informed manner in discussions relating to the appropriateness or application of a particular standard in a given situation, and (2) evaluate the effect that the application of the principles of a given standard will have on the financial results and position of a division or of an entire enterprise.

    Commodity Markets Outlook, October 2025

    Commodity prices are expected to decline by about 7 percent overall this year, reflecting subdued global economic activity, elevated trade tensions and policy uncertainty, ample global supply of oil, and weather-related supply shocks. In 2026, commodity prices are forecast to fall by a further 7 percent, a fourth consecutive year of decline, as global growth remains sluggish and the oil market oversupplied. Energy price movements are envisaged to continue contributing to global disinflation in 2026. Metals and minerals prices are expected to remain stable in 2026, while agricultural prices are projected to edge down, primarily due to strong supply conditions. Precious metals prices are expected to rise another 5 percent, after a historically large, investment-driven rally of about 40 percent in 2025. Risks to the commodity price projections are tilted to the downside. Key downside risks include weaker-than-expected global growth, a longer-than-assumed period of economic policy uncertainty, and additional oversupply of oil. Upside risks include intensifying geopolitical tensions, the market impact of additional oil sanctions, supply reductions stemming from additional trade restrictions, unfavorable weather conditions, faster-than-expected rollout of new data centers. Commodity price volatility in recent years has revived interest in supply management via international commodity agreements. Historical experience, however, shows that the most effective policy is to promote diversification, innovation, transparency, and market-based pricing—measures that build lasting resilience to commodity price volatility.

    The global economy is facing another substantial headwind, emanating largely from an increase in trade tensions and heightened global policy uncertainty. For emerging market and developing economies (EMDEs), the ability to boost job creation and reduce extreme poverty has declined. Key downside risks include a further escalation of trade barriers and continued policy uncertainty. These challenges are exacerbated by subdued foreign direct investment into EMDEs. Global cooperation is needed to restore a more stable international trade environment and scale up support for vulnerable countries grappling with conflict, debt burdens, and climate change. Domestic policy action is also critical to contain inflation risks and strengthen fiscal resilience. To accelerate job creation and long-term growth, structural reforms must focus on raising institutional quality, attracting private investment, and strengthening human capital and labor markets. Countries in fragile and conflict situations face daunting development challenges that will require tailored domestic policy reforms and well-coordinated multilateral support.

    Mining Royalties : A Global Study of Their Impact on Investors, Government, and Civil Society

    Mineral sector regulatory and fiscal systems have been undergoing major reforms across the globe. This book focuses on information and analysis relating to mineral royalties. It provides a general discussion of the concepts behind mining taxation, a guide to royalties, examples of royalty calculations and the ways in which these interact with other forms of taxation, as well as financial effects on investments under varying conditions. Primary information includes royalty legislation from over forty nations. The book discusses implications for investors and governments of various tax regimes and provides specific country case examples. A chapter is included on transparency, governance, and management of revenue streams. The appendices, in the second volume, contain brief summaries and selected statutes relating to royalties in a broad cross-section of nations around the world; sample spreadsheets of the results of mine models that were analyzed; and examples of administrative and distributional approaches to collecting royalties.
